Churn is not an event. It is a process. And the process starts long before any behavioral signal fires. Week 0: Belief drift begins. The user starts noticing that the product is not quite meeting their expectations. The outputs are slightly off. The recommendations are not as relevant. Week 1-2: Compensation behavior. The user adjusts their behavior to compensate for the product’s misalignment. They rephrase prompts more carefully. They edit outputs more heavily. They use fewer features because they have learned which ones do not work well for them. From the outside, usage looks stable. Session duration might even increase because the user is doing more manual work.

Week 3-4: Mental checkout. The user decides, often unconsciously, that the product is not going to get better for them. They start exploring alternatives. They stop investing effort in making the product work. Usage patterns begin to shift, but subtly. Maybe slightly shorter sessions. Maybe slightly less frequent logins. What Belief Drift Looks Like

Belief drift is the progressive misalignment between what the user believes the product should deliver and what the product actually delivers. It is not a catastrophic failure. It is a slow erosion, like a tire losing air. Each individual interaction seems fine. But the cumulative effect is a growing gap.

This dynamic is well-documented at the macro level. SuperOffice reports [5] that 80% of businesses believe they deliver excellent customer experience, but only 8% of customers agree. That 72-percentage-point perception gap is the organizational version of belief drift: companies lose touch with what their users actually experience.

Here are the specific signals of belief drift that behavioral models miss.

Output modification rate increase. When a user starts editing AI outputs more heavily, they are compensating for misalignment. The product is generating content that is close but not right. The user is doing more work to bridge the gap. Login frequency has not changed, session duration might even increase. But satisfaction is declining.

Narrowing usage patterns. When a user stops using features they previously used regularly, they have learned those features do not work well for them. Prompt sophistication increase. When a user starts crafting more elaborate, specific prompts, they are trying harder to get the product to understand them. This is a compensation behavior. Building Belief Drift Detection

Detecting belief drift requires a different kind of model than behavioral churn prediction. Instead of tracking what the user does, you track whether what the product delivers matches what the user expects.

This requires two things: a model of the user (the self-model) and a way to measure alignment between the self-model’s predictions and the user’s actual responses.

The Alignment Score

At the core of belief drift detection is the alignment score: a continuous measure of how well the product’s output matches the user’s self-model.

The alignment score is not a single number. It is a composite of alignment across observation contexts. A user might be well-aligned on communication style (the product matches their tone preferences) but poorly aligned on domain expertise (the product explains things at the wrong level). The composite score shows overall health; the context-level breakdown shows where drift is occurring.

Tracking the alignment score over time reveals the drift pattern. A user with a stable alignment score of 0.82 is well-served by the product. Intervention That Works

Early detection is only valuable if you can intervene effectively. This is where belief drift detection has a second advantage: it tells you how to intervene, not just when.

Behavioral churn models tell you a user is at risk. But they do not tell you why. Is it feature fatigue? Pricing? A competitor? Bad personalization? The behavioral model cannot distinguish between causes. So intervention is generic: send a discount, offer a call, highlight new features. Belief drift detection tells you exactly which observation contexts are drifting. If the user’s domain expertise context is misaligned, the product is explaining things at the wrong level. If the communication style context is drifting, the product’s tone is off. If the collaboration context is misaligned, the product is suggesting workflows that do not match how the user works.

This means interventions can be precise. Instead of generic outreach, the product can automatically adjust personalization in the drifting contexts. Reduce explanation complexity for a user whose expertise has grown. Shift to a more concise tone for a user who has started editing outputs for brevity. Suggest different workflows for a user whose collaboration patterns have changed. Trade-offs

Belief drift detection requires self-model infrastructure. You cannot detect belief drift without a structured model of user expectations. If your product does not track observation contexts and alignment scores, belief drift is invisible. This is a meaningful infrastructure investment, not a simple model addition.

Alignment scores require calibration. A declining alignment score does not always mean the user is drifting toward churn. Sometimes users are growing; their needs are evolving and the product has not caught up. The distinction between growth-driven misalignment (which is temporary and correctable) and dissatisfaction-driven misalignment (which leads to churn) requires careful calibration.

False positives in the early window. Detecting drift earlier means detecting more noise. Short-term alignment fluctuations (a user having a bad day, a temporary context shift) can look like drift. The scoring system needs smoothing and threshold tuning to avoid alert fatigue.

Intervention design is its own discipline. Knowing which observation context is drifting is necessary but not sufficient. You still need to design what the product does differently when drift is detected.
